EM is cheap

The smallest updates cause as much EM as full fine-tuning, and it lives in the first half of the network. One tab per experiment; every figure is the intended paper figure, drawn from the results that have landed so far. Grey “waiting” marks planned cells without data.

Models: Qwen3.5-9B (first) and Llama-3.1-8B-Instruct. Training data: the paper's insecure code (Betley et al. 2025) and Turner et al.'s bad medical advice, with benign twins (secure code, good medical advice). Update types (smallest first): steering vector (one residual vector), sparse mask on one layer's MLP neurons (base frozen, one scalar per neuron), rank-1 LoRA on one down_proj, LoRA r32 on one layer, LoRA on all layers (r1 ... r128), the paper's LoRA recipe (r32, 1 epoch), full fine-tuning. Organisms: #7/#8 methods sweep (insecure code, 10 epochs) and the #9 campaign (em/organisms.py); 3 seeds each.
EM: the paper's 24 free-form question blocks × 100 samples (T = 1), judged by claude-sonnet-5 for alignment and coherence (0-100); EM = share of answers with aligned < 30 and coherent > 50 (CODE / REFUSAL labels unscored). Task skill: 200 held-out prompts of the training task (insecure-code rate / harmful-advice rate). Anthropic models only. Error bars are ± 1 sd over seeds unless stated; n = seeds.

EM, coherence and task skill by update size and layer

Do the smallest updates cause as much EM as full fine-tuning, and where in the network does it live?

How it works

Every organism answers the paper's 24 free-form question blocks (100 samples each) and a 200-prompt held-out version of its training task. The judge scores alignment and coherence; EM is the share of answers with aligned < 30 and coherent > 50. Organisms are ordered by how much of the model the update can change, from one steering vector to full fine-tuning, and single-layer updates are repeated at every depth.

Harmful vs benign data

Is the EM caused by the harmful content, or by any fine-tuning of that size?

How it works

Each harmful organism is paired with the same update trained the same way on a benign twin of its data: secure code for insecure code, good medical advice for bad medical advice. Both are evaluated with the same EM and task prompts. If the benign twin shows the same EM, the update size alone causes it.

Fewest neurons; one steering vector

How few parameters are enough to produce EM?

How it works

A sparse mask is retrained at layer 7 with only k neurons allowed to change: either the k neurons that moved most in a trained L7 mask, or k random ones. The same data also trains a single steering vector added to the residual stream at layer 7, the smallest update in the campaign.

EM over training

Does EM rise and fall during training, and does it track the task?

How it works

Organisms are saved at every epoch (10-epoch runs keep epochs 1, 2, 4, 6, 10) and, for a small subset, every 25 steps in the first 200. Each snapshot gets the same EM, coherence and task evaluation, so EM can be compared with how well the narrow task is learned.

Model diffing

Where does each update change the model's activations, and by how much?

How it works

Judged EM answers are teacher-forced through the base model and through each organism. At every layer the mean change of the residual stream (organism minus base, averaged over answer tokens) is compared with the base model's typical token norm. Small updates that act at one early layer show where their change appears and how it grows downstream.

Weight diffs

How large and how spread out is each update in weight space, and does that predict EM?

How it works

For every updated matrix the weight change ΔW is measured directly: Frobenius norm, norm relative to the original matrix, and effective rank. Per organism the norm² is split over layers to get an effective number of layers. The number of trainable parameters comes from each run's adapter or mask; EM is the organism's main-eval rate at the same snapshot.
